A model performs almost perfectly during evaluation but fails on new records. The suspicious score may come from information that would not exist at prediction time.

Why this happens

Leakage occurs when training benefits from future outcomes, test-set statistics or related records placed on both sides of a split. A sophisticated algorithm cannot repair an invalid experiment.

Step-by-step solution

1. List when each feature becomes available relative to the prediction. Remove fields derived from the eventual outcome, such as refund status when predicting an initial purchase.

2. Split before fitting learned preprocessing. Fit transformations on training data and apply the fitted transformation to validation data.

3. Use a Pipeline inside cross-validation and choose group-aware or time-aware splits when the data requires them.

Worked example

from sklearn.pipeline import make_pipeline
from sklearn.preprocessing import StandardScaler
from sklearn.linear_model import LogisticRegression
model = make_pipeline(StandardScaler(), LogisticRegression(max_iter=1000))
# Fit this pipeline only on the training partition.

Verify the fix

Compare results after removing suspect features and enforcing a realistic split. A lower score may be a more honest estimate rather than a regression in the application.

Prevent a repeat

Document feature availability and retain a final untouched evaluation set. Review unusually strong scores with the same care as poor ones.
